Synthetic Data Generation (SDG) is a technique for creating high-quality, artificial data using large language models (LLMs) to supplement limited or sensitive real-world datasets.
How SDG Works
SDG uses a “teacher” model (e.g., GPT-4) to generate demonstrations, instructions, or synthetic conversations for a smaller “student” model (e.g., Llama-3 8B).
- Prompting: The teacher model is given few-shot examples or specific instructions to generate new data.
- Filtering: The synthetic data is cleaned using automated scripts or a second-pass “critic” model to remove noise.
- Training: The high-quality synthetic data is then used to fine-tune a smaller model.
Why Use SDG?
- Privacy: Generate artificial data for sensitive datasets like medical records.
- Scarcity: Create data for niche tasks or languages where real-world data is lacking.
- Alignment: Generate “reasoning” traces for training chain-of-thought (CoT) capabilities.
- Cost: Synthetic data is often much cheaper than manually labeling millions of samples.
