Mechanistic Interpretability: Peering into the Black Box

Large Language Models are often called “black boxes,” but the field of Mechanistic Interpretability aims to change that. Researchers treat neural networks like biological systems, using “neuroscience” techniques to map out their circuits.

Core Concepts

1. Features and Circuits

Just as a brain has regions for specialized tasks, neural networks develop “circuits” for specific concepts, like identifying a person’s name, handling punctuation, or understanding sentiment.

2. Superposition

Models often store more features than they have dimensions by using a mathematical trick called Superposition. This allows them to be incredibly efficient but makes it much harder to interpret their internal states.

3. Sparse Autoencoders (SAEs)

SAEs are a breakthrough tool used to “disentangle” the complex activations inside an LLM, making it possible to identify which specific neurons are firing for a given concept.

Why Interpretability Matters

If we understand how a model thinks, we can:

  • Hardwire Safety: Directly disable pathways that lead to harmful behavior.
  • Debug Logic: Find out why a model is making a specific reasoning error.
  • Verify Knowledge: See if a model is “hallucinating” or truly retrieving a stored fact.
